# Evaluating LLM Output

## Overview

LLM behavior shifts whenever you change a prompt, swap a model, or add a tool, and the shift is easy to miss because the output is free-form text instead of a value you can assert on. Ordinary unit tests don't catch it. An eval suite is the regression test for an LLM app: a fixed set of inputs you re-grade on every change, so a quality drop shows up in CI instead of in user complaints.

This is the model-output counterpart to `test-driven-development`. Use TDD for the deterministic code around the model; use evals for the part that returns natural language.

## When to Use

- Editing a prompt or system instruction that's already in production
- Swapping models or accepting a model version bump
- Adding or changing a tool the agent can call
- Shipping an LLM feature you intend to keep working over time
- When the only QA today is running it by hand a few times

## Process

### 1. Build a golden set

Keep a versioned file of representative inputs paired with the expected outcome or pass criteria. Start with 20 to 50 real cases, including the failures you've already seen in production. Store it in the repo next to the code so it's reviewed and versioned like everything else.

### 2. Grade each case with the cheapest method that works

Assert wherever the output is structured. Save the judge for genuinely open-ended text, and don't spend a model call checking something a schema or regex already covers.

### 3. Test behavior, not just final text

For agents, the costly failures are calling the wrong tool, passing the wrong arguments, or not recovering after a tool error. Assert on the trajectory: which tool ran, with what arguments, whether the task completed, and whether it recovered from an injected failure.

### 4. Include negative and safety cases

Happy-path-only cases give false confidence; the inputs that reach users are the ones nobody wrote a case for. Add must-refuse inputs, prompt-injection attempts, malformed inputs, and every known-bad case that has bitten you before. From then on, add one case per incident.

### 5. Run it in CI and block on regression

Wire the suite into CI so it runs on any change to a prompt, model, or tool, with a pass threshold that fails the build when quality drops. See `ci-cd-and-automation` for the pipeline setup; this adds the eval gate on top of it.

### 6. Track the numbers over time

Record pass rate, cost, and latency per run and watch the trend. A drift from 94% to 88% across several merges is a regression even though no single run failed.

### Handling non-determinism

Pin temperature and seed where the API supports it. For judged or sampling-sensitive cases, run several samples and require k-of-n rather than a single pass. When a case turns flaky, stabilize it or quarantine it; deleting it to get a green build hides the regression.

## Common Rationalizations

| Excuse | Reality |
|---|---|
| "Our output is too open-ended to test." | Rubric-based grading handles open-ended text. You score against criteria instead of an exact string. |
| "We check it by hand before shipping." | By hand you check the cases you happen to think of, once. A golden set checks all of them on every change. |
| "Evals are a whole project." | A 20-case JSONL with three assertions in CI beats nothing. Start there and grow it. |
| "The new model is strictly better." | Maybe on the vendor's benchmark. Run your suite on your task and your format before you believe it. |
| "We'll add evals after launch." | Launch is when prompt changes happen fastest, which is when regressions ship. |

## Red Flags

- No file of expected inputs and outputs anywhere; QA is "I ran it a few times"
- Prompt changes merge with no automated check
- A model or version bump with no before/after comparison
- Cases cover only the happy path, with no must-refuse, injection, or malformed inputs
- Flaky cases get deleted instead of stabilized

## Verification

- [ ] A versioned golden set of at least 20 representative cases lives in the repo
- [ ] Each case is graded automatically by an assertion or a rubric judge, not by eye
- [ ] Agent behavior and tool use are asserted, not just the final text
- [ ] Negative, safety, and known-regression cases are included
- [ ] Evals run in CI on prompt, model, and tool changes and block merges below a pass threshold
- [ ] Pass rate, cost, and latency are tracked across runs over time
